Zhihao Jia introduces SentryWard, an open-source formal verifier for GPU kernels

AISummary

Zhihao Jia and collaborators introduce SentryWard, an open-source tool that formally verifies GPU kernels against all possible execution schedules within a specified configuration. The team says it can detect deadlocks and data races, and it can also verify removal of unnecessary waits, yielding kernels up to 1.4× faster on NVIDIA B200 GPUs.

Can You Trust AI-Generated GPU Kernels? Introducing SentryWard

We analyzed 85 GPU kernels from popular libraries and found 32 with potential data races, synchronization bugs, or resource lifetime violations.

As AI coding agents increasingly generate and optimize GPU kernels, ensuring their correctness is becoming a critical challenge.

Modern GPU kernels use asynchronous memory transfers, tensor cores, and complex synchronization primitives to maximize performance. A single missing barrier or incorrectly ordered asynchronous operation can lead to silent data corruption, deadlocks, or crashes.

The tricky part? These bugs can hide in rarely encountered execution schedules. A GPU kernel might pass 100,000 tests and still produce incorrect results or deadlock when concurrent operations execute in a different order.

🧿 Introducing SentryWard: an open-source tool for formally verifying GPU kernels.

Unlike conventional testing, which samples execution schedules, SentryWard mathematically reasons about all possible execution schedules within a specified configuration and hardware model.

It can automatically verify:

✅ Synchronization safety: Detect incorrect barrier usage and potential deadlocks.

✅ Data-race freedom: Prove that concurrent accesses to global, shared, and tensor memory are correctly ordered.

✅ Resource lifetime safety: Catch invalid accesses to deallocated tensor memory or barriers.

✅ Mathematical correctness: Prove equivalence to a PyTorch reference implementation.

SentryWard analyzes compiled NVIDIA PTX and supports advanced GPU features, including TMA, asynchronous tensor-core operations, and mbarriers.

⚡ Surprisingly, formal verification can also make GPU kernels FASTER!

We discovered that both AI agents and human experts tend to be overly conservative when writing warp-specialized kernels, introducing unnecessary synchronization and waits that limit performance.

SentryWard turns this into an optimization opportunity.

Instead of blindly removing synchronization and hoping tests still pass, we can systematically remove waits and formally verify whether the modified kernel remains race-free and correct. If verification succeeds, we keep the optimization. Otherwise, we restore the synchronization.

Our results on NVIDIA B200 GPUs:

🔥 42% of synchronization operations can be safely eliminated among our evaluated kernels with specific input configurations (https://sentryward.io/results/).

🔥 Up to 1.4× faster kernels, simply by removing unnecessary waits, without changing the underlying computation.

This demonstrates a powerful new role for formal verification: not just proving that GPU kernels are correct, but also enabling aggressive performance optimizations that would otherwise be too risky.

🚀 Toward Fully Automated, Verified GPU Kernel Optimization

Our vision is to enable a fully automated workflow for GPU performance optimizations:

AI Agents → Generate Kernel → Formally Verify → Fix & Optimize → Repeat

AI agents can aggressively explore kernel optimizations, including removing unnecessary synchronization, while SentryWard formally verifies that the resulting kernels remain correct within the specified configurations and model assumptions.

Formal verification can transform GPU kernel optimization from trial and error into a systematic, correctness-guided process.

As AI agents make GPU kernel generation increasingly accessible, we believe formal verification will become an essential part of the GPU programming workflow.

Don't just test your GPU kernels. Prove them correct and make them faster.
